A new paper claims to solve the "demonstration scarcity" problem with synthetic data

The simulator gap is the long-recognised problem that learned and physics-based simulators diverge from reality in ways that matter for robot learning. Models trained on simulator-only data tend to perform well in the simulator and poorly on real hardware. Synthetic-data approaches that work in benchmark settings have a history of failing in production deployments.

The paper does report some real-hardware evaluation, but the test set is narrower than the simulator-based benchmarks. The conventional wisdom is that the real test is whether the method survives a year of deployment on production robots, which we will not know until at least 2027.

What is likely next

Three things, in roughly equal probability.

The first is that the result generalises broadly, and the field genuinely solves the demonstration bottleneck. Real-world deployments using synthetic-data-trained models would multiply rapidly.

The second is that the result generalises in some domains but not others, and the field develops a more nuanced understanding of when synthetic data is sufficient. This is the historically most common outcome for big claims in machine learning.

The third is that the result mostly fails to generalise once the simulator gap is exercised in production conditions, and researchers go back to the demonstration-scarcity drawing board.

We will know within twelve months which of these is closer to true. In the meantime, the paper is the most credible attempt yet at the demonstration bottleneck, and worth reading in full.
